How to Build an AI Proof of Concept in 2 Weeks

A fast-track approach to validating AI features before committing to full development.

Your team has an idea for an AI-powered feature. Maybe it is a document classifier that routes support tickets automatically, a recommendation engine that surfaces relevant products, or a natural language search interface that replaces a dozen dropdown filters. The idea sounds promising, but nobody knows if it will actually work with your data, your users, and your constraints.

This is the moment where most companies make one of two mistakes. They either spend six months building a full production system that turns out to solve the wrong problem, or they talk about it in meetings for a year and never build anything. The correct move is in between: build a focused proof of concept in two weeks that answers the critical unknowns before committing real resources.

A two-week AI proof of concept is not a toy demo. Done correctly, it produces a working system that ingests real data, generates real outputs, and gives stakeholders enough evidence to make a confident go or no-go decision. Here is how to structure those fourteen days.

Days 1-2: Define the Single Question Your POC Must Answer

The most important work happens before you write any code. A POC that tries to prove everything proves nothing. You need to isolate the single riskiest assumption about your AI feature and design the entire two weeks around testing it.

Common riskiest assumptions include: Can the model achieve acceptable accuracy on our specific data? Will the latency be low enough for real-time use? Can we get the cost per inference below a viable threshold? Do users actually want this capability, or are we building something nobody asked for?

Write the assumption as a falsifiable hypothesis. Not “AI can help with customer support,” but “GPT-4o can classify incoming support tickets into our 12 existing categories with at least 85% accuracy using only the ticket subject and first 200 words of body text.” This specificity is what makes the POC actionable.

Define your success criteria numerically. What accuracy percentage makes this viable? What latency is the maximum acceptable? What cost per request is sustainable at your projected volume? Write these numbers down and get stakeholder agreement before day three. Moving the goalposts mid-sprint kills POCs.

Days 3-5: Assemble Your Data and Build the Pipeline

AI systems are only as good as the data feeding them. Days three through five are about getting real, representative data into a format your model can consume.

Start with the data you already have. For the support ticket classifier example, export 1,000 to 5,000 recent tickets with their existing category labels. If you do not have labeled data, you will need to create a labeling session — get two team members to manually label 500 examples in a shared spreadsheet. This takes roughly four hours and is non-negotiable. Skipping this step means you have no ground truth to evaluate against.

Clean the data ruthlessly. Remove duplicates, strip HTML artifacts, handle encoding issues, and standardize the label set. A common pitfall is discovering that your “12 categories” actually contain 47 variations due to typos and inconsistent naming. Normalize now.

Build a minimal data pipeline using straightforward tools. A Python script that reads from a CSV or database, formats prompts, calls the API, and writes results to another CSV is perfectly adequate for a POC. Do not build a production-grade pipeline with message queues, retry logic, and monitoring. That comes later. Use a Jupyter notebook or a simple script.

If you are using a large language model via API (OpenAI, Anthropic, etc.), design your prompt template during this phase. For classification tasks, few-shot prompting with 3-5 examples per category often outperforms zero-shot by 15-25 percentage points. Test a handful of examples manually before running the full batch.

Days 6-8: Run Experiments and Measure Results

With data and pipeline in place, days six through eight are for systematic experimentation. Run your model against your evaluation dataset and measure performance against the success criteria you defined on day two.

Structure your experiments as a grid. Vary one dimension at a time: prompt strategy (zero-shot vs. few-shot vs. chain-of-thought), model selection (GPT-4o vs. GPT-4o-mini vs. Claude Sonnet), temperature settings (0.0 vs. 0.3 vs. 0.7), and input preprocessing (full text vs. truncated vs. summarized). Log every experiment with its parameters and results in a spreadsheet or simple tracking system.

For classification tasks, compute precision, recall, and F1 score per category, not just overall accuracy. Aggregate accuracy can hide catastrophic failures in low-frequency categories. If your model gets 95% accuracy overall but misclassifies “billing dispute” tickets 60% of the time, you have a problem that the headline number masks.

For generative tasks (summarization, content creation, chatbot responses), automated metrics are less reliable. Use a combination of automated checks (response length, format compliance, keyword presence) and human evaluation. Have two evaluators rate 100 outputs on a 1-5 scale for relevance, accuracy, and completeness. Calculate inter-rater agreement to ensure your evaluation is consistent.

Track cost per request during this phase. If you are calling GPT-4o at $2.50 per million input tokens and your average request uses 2,000 tokens, that is $0.005 per request. At 10,000 requests per day, that is $50 daily or $1,500 monthly. These numbers matter. If the model that meets your accuracy threshold costs $15,000 per month at projected volume, you need to know that now.

Days 9-11: Build a Minimal Interface for Stakeholder Review

Numbers on a spreadsheet do not persuade executives. A working demo does. Days nine through eleven are for wrapping your AI pipeline in a minimal interface that stakeholders can interact with directly.

This does not need to be beautiful. A Streamlit app, a simple Next.js page, or even a Slack bot will do. The interface needs to accept an input (paste a support ticket, upload a document, type a question), send it through your pipeline, and display the result with the confidence score or relevant metadata.

Build in a feedback mechanism. Add a thumbs-up and thumbs-down button next to each result. This gives you real qualitative signal from stakeholders and future users. During your demo, ask people to try it with cases they know the answer to. Their reactions to correct and incorrect outputs will tell you more than any metric.

Include a side-by-side comparison view if possible. Show the AI output next to the current manual process result. If your ticket classifier matches the human-assigned category 88% of the time, showing that directly is more persuasive than stating a number.

If latency is a concern, display the response time for each request. Stakeholders need to feel the performance, not just hear about it. A system that returns results in 400 milliseconds feels instant. One that takes 8 seconds feels broken, even if the output is perfect.

Day 12-13: Document Findings and Production Requirements

With experiments complete and stakeholder feedback collected, days twelve and thirteen are for synthesis. Compile your findings into a brief, decision-oriented document.

The document should cover five areas. First, results against success criteria: did you hit the numbers? Be honest. If accuracy was 78% against an 85% target, say so, but also explain what would likely close the gap (more training data, fine-tuning, better prompts, a different model). Second, cost projections: what will this cost at production volume? Include model API costs, infrastructure costs, and the engineering time to build and maintain the production system. Third, technical risks: what could go wrong? Model degradation over time, data drift, adversarial inputs, API rate limits, and vendor lock-in are common risks. Fourth, production requirements: what infrastructure, monitoring, and human-in-the-loop processes are needed? Fifth, recommended next steps: build, iterate, or kill.

Be candid about what the POC did not test. A two-week POC cannot validate long-term model drift, edge cases in the long tail, or user adoption at scale. Name these gaps explicitly so stakeholders understand what remains uncertain.

Day 14: Present, Decide, and Plan the Path Forward

The final day is for the decision meeting. Present your findings to the stakeholders who will fund or kill the project. Structure the presentation around the original hypothesis, the evidence, and the recommendation.

If the POC succeeded, propose a phased production plan. Phase one: build the production pipeline with monitoring, error handling, and human review for low-confidence outputs. Phase two: integrate into the existing product workflow. Phase three: expand to additional use cases. Estimate each phase in weeks, not months. If the POC took two weeks, phase one should take four to six weeks, not four to six months.

If the POC failed, explain why and whether the failure is fixable. Sometimes the answer is “this model cannot do this task with this data,” and the right move is to stop. Other times the answer is “we need 10x more labeled data” or “we need a different modeling approach,” and the right move is a second, targeted POC.

The worst outcome is ambiguity. If your POC did not produce a clear signal, the hypothesis was too broad or the success criteria were too vague. Learn from that and tighten the scope if you run another one.

Two weeks is enough time to separate AI hype from AI value for your specific business. The discipline is in staying focused, measuring honestly, and letting the evidence drive the decision.
